Machine learning classification problem: summary of nine commonly used evaluation indicators

Evaluation metrics for machine learning are the core part of machine learning. This article summarizes commonly used evaluation indicators for classification problems.

Here, various performance metrics that can be used to evaluate predictions for classification problems will be discussed.

1. Confusion Matrix

This is the simplest way to measure the performance of classification problems, where the output can be two or more types of classes. Confusion Matrix is ​​nothing but a table with two dimensions i.e. "Actual" and "Predicted", furthermore both these dimensions have "True Positive (TP)", "True Negative (TN)", "False Positive ( FP)" and "False Negative (FN)" as follows:

    True Yang (TP) − When the actual class and predicted class of the data point are both 1
  • True Yin (TN) − When the actual class and predicted class of the data point are both 0
  • False Positive (FP) − When the actual category of the data point is 0, the predicted data point category is 1
  • False Negative (FN) − When the actual category of the data point is 1, the predicted The data point category is 0
We can use sklearn's confusion matrix function confusion_matrix to calculate the metric of the confusion matrix of the classification model.

2. Accuracy

It is the most common performance measure of classification algorithms. It can be defined as the ratio of the number of correct predictions to all predictions. We can easily calculate it through the confusion matrix with the help of the following formula:

We can use sklearn’s accuracy_score function to calculate the indicator of classification model accuracy

3. Precision

Precision is defined as the number of correctly predicted positive samples divided by the number of all predicted positive samples in the ML model prediction result:

4. Recall

recall is defined as the number of correctly predicted positive samples divided by the number of actual positive samples in the ML model prediction result:

5. Specificity

Specificity is defined as the number of correctly predicted negative samples divided by the number of actual negative samples in the ML model prediction result:

6. Support

Support can be defined as the corresponding number of samples in each type of target value.

7. F1 Score

This score will provide us with the harmonic mean of precision and recall. Mathematically speaking, the F1 score is the weighted average of precision and recall. The best value of F1 is 1 and the worst value is 0. We can calculate the F1 score using the following formula:

The relative contribution of the F1 score to precision and recall is equal.

We can use the classification_report function of sklearn to obtain the metrics of the classification report of the classification model.

8. AUC (Area Under ROC curve)

AUC (Area Under ROC curve)-ROC (Receiver Operating Characteristic) is a performance indicator for classification problems based on different thresholds. As the name suggests, ROC is a probability curve and AUC measures separability. Simply put, the AUC-ROC metric will tell us the model's ability to distinguish between classes, the higher the AUC, the better the model.

Mathematically speaking, we can plot TPR (true positive rate) under different thresholds, that is, specificity or recall and FPR (false positive rate). The figure below shows ROC, AUC, and the y-axis is TPR. The x-axis is FPR:

9. LOGLOSS (Logarithmic Loss)

It is also called logistic regression loss or cross-entropy loss. It is basically defined on probability estimation and measures the performance of a classification model where the input is a probability value between 0 and 1.

By making precise distinctions, it can be understood more clearly. As we know, accuracy is the count of predictions in our model (predicted value = actual value), while log loss is the amount of uncertainty in our prediction, based on how different it is from the actual label. With the log loss value, we can get a more accurate picture of the model's performance. We can use sklearn’s log_loss function.
